How do you tune Regression models without predicting the average?

I'm trying to tune a model, but it keeps predicting the average output value instead of predicting something like the actual output movement, because predicting the average also decrease MAE (the metric I am using). The same problem is there with out regression metrics like RMSE.
It's nonlinear regression so I can't use R2 as a metric.
Is there another metric or something else I can do to get the model to stop predicting the average?
